An Interpretable BO-TCBDA Deep Learning Framework for Winter Wheat Yield Estimation Using Multi-Source Remote Sensing Data

可靠的作物产量估算是粮食安全和高效农业管理的基础。然而,当前深度学习模型在选择和整合多源特征方面仍存在局限性,且其高预测精度往往伴随着有限的解释性。本研究引入了一种贝叶斯优化-时序卷积网络-双向长短时记忆-双注意力(BO-TCBDA)深度学习框架用于冬小麦产量估算。以中国河南省为研究区域,利用2013—2022年的增强植被指数(EVI)、叶面积指数(LAI)、太阳诱导叶绿素荧光(SIF)和气候数据估算了县级冬小麦产量。所提出的模型与五种常用机器学习和深度学习模型进行了比较。BO-TCBDA取得了最佳性能,R²为0.823,RMSE为561.26 kg/ha。SIF提高了所有模型的预测性能,深度学习模型中观察到具有统计学显著性的增益。双注意力机制通过揭示输入特征之间相对平衡的贡献并提供时序注意力突出灌浆阶段,提供了可解释的见解。此外,基于SHAP的交叉验证分析识别出对应于拔节期后期的T12时期是产量预测贡献最高的时期。该模型在收获前约25天实现了约0.80的R²。总体而言,BO-TCBDA为县级冬小麦产量估算提供了一种准确且可解释的方法,并支持区域粮食安全评估和精准农业。
