• Introduces a novel 3D-SM as a dynamic fingerprint for at-line sludge monitoring. • Achieves high-fidelity detection of MLSS, SV30, and SVI30 (test set R2> 0.953). • Shows low sensitivity to tested environmental factors within the evaluated range. • Provides 71-day cross-site validation at one industrial AO treatment plant. • Supports threshold-based sludge assessment, exploratory ID of filamentous enrichment.
